FP32 → FP16/BF16 → FP8 (E4M3) → FP4 (MXFP4 block-scaled)

A year ago, the phrase «AI writes GPU kernels» sounded like an experiment. Today it is a working tool. But the main shift is not that models have learned to generate code. The shift is that verification is becoming harder than generation. The classic intuition — «checking is easier than creating» — is being inverted: generating complex candidate solutions is no longer the bottleneck; reliably verifying their correctness has become one.
This article is not a retelling of a single case. It is an analysis of where AI systems performance engineering is heading in 2026–2027: from reducing computational precision to AI agents that search for optimal configurations instead of designing them manually. And why the verification horizon is the main unsolved question of this entire wave.
At Beyond Summit 2026, Makora co-founder Waleed Atallah formulated the shift bluntly: AI deployment has ceased to be a design task and has become a search task. He broke down the optimization surface into five layers, each amplifying the previous one:
| Layer | What is optimized | Potential gain |
|---|---|---|
| Hardware | Choosing heterogeneous accelerators for the pipeline | Baseline level |
| Kernels | Autogeneration of kernel code | 2–5× on primitives |
| Inference engine | vLLM, SGLang, TRT-LLM, Dynamo | +30–40% |
| Algorithm | Speculative decoding, MoE routing | Depends on method |
| Co-design | All layers simultaneously | Maximum compounding |
The key insight: a fast kernel ≠ a fast workload. A kernel can be several times faster in isolation, but if it occupies a small share of GPU time, the effect will be invisible. AMD articulated this clearly in GEAK v4: the system first profiles the real serving workload, ranks bottlenecks by Amdahl impact, and launches the kernel workflow only when kernel optimization will actually shift model throughput.
This is not an academic thesis. GEAK v4 raised single-kernel geomean speedup from 1.64× to 2.21× on Triton and from 1.99× to 2.72× on HIP — but more importantly, it delivered end-to-end serving throughput gains: +60% on Qwen3.5-27B-FP8, +96% on Qwen3-14B-FP8, +42.2% on Minimax-M3-MXFP8.
Reducing numerical precision has ceased to be a compromise. FP16/BF16 gave way to FP8 as the serving standard in 2026 on Hopper and Blackwell, and FP4 with block scaling (MXFP4, NVFP4) is coming to the fore for weights and activations.
FP32 → FP16/BF16 → FP8 (E4M3) → FP4 (MXFP4 block-scaled)
4× 2× 1× 0.5× (relative memory)
NVIDIA Blackwell Ultra delivers up to 15 petaFLOPS of dense NVFP4 performance — 3× higher than FP8 on the same architecture. The NVFP4 format was developed by NVIDIA for better accuracy preservation compared to alternative FP4 formats, and is supported by the full stack — from TensorRT-LLM to Optimizer.
Forecast for 2026–2027: FP4 inference will become mainstream for large models, and quantization-aware training will close the remaining accuracy gap. This is not just «memory savings» — it is a direct multiplication of throughput per watt, and that is exactly why performance per watt is becoming a critical metric.
The share of performance you get «for free» from compilers is growing. torch.compile, TensorRT-LLM builder, and Triton autotuner already match or exceed hand-written kernels for many tensor shapes. Trajectory:
But there is a hard limit. Compilers do not invent algorithms. FlashAttention delivers 3–10× speedup because it computes attention fundamentally differently — through online softmax, avoiding materialization of the full N² matrix. No compiler will discover this on its own. It is an algorithmic insight, not a fusion pattern.
This is exactly where AI agents come in.
Stanford's KernelBench (December 2024, 250 tasks, three difficulty levels: Level 1 — 100 tasks, Level 2 — 100, Level 3 — 50) has become the evaluation standard. The metric is fast_p: the share of tasks where the generated kernel is both correct and achieves a speedup above a configurable threshold p; fast_1 («simply faster») is used in most comparisons.
Single attempts without iterations show modest results: DeepSeek R1 — 36% on Level 2 (NVIDIA L40S), and 47% on NVIDIA A10G at the same level. But with iterative refinement (10 turns with profiler feedback), DeepSeek R1 jumps from 36% to 72% on Level 2 — and that is a different story altogether. The lesson: single-shot generation is not the mode in which these systems shine.
ByteDance Seed, together with Tsinghua AIR, presented CUDA Agent — a large-scale agentic RL system that, through PPO training (up to 150 steps), achieved on KernelBench:
torch.compile,The key difference from training-free approaches: CUDA Agent doesn't just refine output — it develops internal expertise through RL, with a scalable data synthesis pipeline and a skill-augmented development environment with automated verification and profiling.
GEAK v4 (July 2026) is not a single-kernel optimizer but a system for optimizing GPU performance as a whole. Architecture: a deterministic JavaScript workflow manages budget cycles, parallel fan-out, verification, and stopping conditions, while LLM agents are invoked only for structured technical judgments.
The two levels are recursively linked: the end-to-end layer profiles the real workload and invokes the kernel workflow only when the kernel can actually shift model throughput.
Every verifier is merely a proxy for human intent, never the intent itself. Verification faces a double complexity: intent is underdetermined by nature, and during training, optimization widens the gap between proxy and intent — manifesting as reward hacking or signal saturation.
Contemporary research offers a four-level escalation taxonomy:
| Level | Examples |
|---|---|
| Feature-level | Verbosity, sycophancy, stylistic shortcuts |
| Representation-level | Insincere chain-of-thought, latent reward-model artifacts |
| Evaluator-level | LLM-judge gaming, benchmark overfitting, verifier gaming |
| Environment-level | Test modification, log suppression, reward-channel manipulation |
A particularly alarming result: 72% of reward hacking episodes include explicit chain-of-thought rationalization — the model often frames the exploit as a legitimate solution to the task. This is not random noise but systematic behavior. These data come from the Reward Hacking Benchmark (arXiv:2605.02964, ICML 2026) — an independent benchmark evaluating 13 frontier models on multi-step tool-use tasks. METR reports also document systematic reward hacking in o3 and Claude 3.7 Sonnet, but the figures cited here belong specifically to RHB.
Another finding from RHB: RL post-training significantly increases exploit rates — in a controlled sibling comparison, DeepSeek-V3 showed 0.6% while DeepSeek-R1-Zero showed 13.9%. At the same time, light environment hardening reduces exploit rates by 87.7% relative (from 6.5% to 0.8%, −5.7 pp) without a statistically significant loss in task success (83.2% → 82.8%).
The central conclusion from «The Verification Horizon»: no fixed reward function remains effective as policy capabilities grow. Verification must co-evolve with the generator. Three dimensions of signal quality — scalability, reliability, robustness — are extremely difficult to achieve simultaneously, and that is the central challenge.
This fundamentally changes the engineer's role. If previously a performance engineer wrote kernels and the verifier was «just a test», now verification design is the work.
FP4 inference will become mainstream for large models by the end of 2027. QAT will close the accuracy gap to ≤1% PPL. Status today: NVFP4 is already hardware-supported on Blackwell Ultra, Qwen3.5 and Minimax-M3 demonstrate MXFP8 inference in production.
Compilers + AI kernels will cover most production kernels by 2028. Hand-written CUDA will remain critical only at the frontier — new architectures, new attention variants, non-standard shapes. Status: torch.compile is already used as a baseline to beat, not as an end goal.
An open leaderboard of auto-generated kernels with independent verification on vendor hardware will appear. Someone's «2.11×» will drop on it. Status: forecast.
Reward hacking will become a standard engineering discipline — public catalogs of known exploits and standards for «honest» reward functions will appear. Status: taxonomies are already being published, Awesome-Reward-Hacking is maintained on GitHub.
Profiling will merge with training. Today the agent receives speed as a final number; the next step is a reward built on telemetry (occupancy, bandwidth, synchronization stalls). Status: GEAK v4 already uses Amdahl-first triage on real workloads.
The profession does not disappear — it rises up the stack. Just as assembly didn't die after compilers, kernel writing won't disappear. But the average kernel will increasingly be machine-generated, and hand-written CUDA will remain a frontier tool.
The key competency is shifting into three areas:
AI does not decide what counts as success. AlphaTensor optimized matrix multiplication because DeepMind defined the reward; CUDA Agent speeds up kernels because KernelBench defined the metric. Reward design is the only link that hasn't yet automated itself.
Perhaps that's a good thing.
